Spiking Neural Network (SNN) refers to a class of artificial neural networks that processes information using discrete, binary spike events and simulates the analog/digital hybrid signal processing found in biological nervous systems. In SNNs, computation emerges from the temporal dynamics of neuron models such as the leaky integrate-and-fire (LIF) neuron, as well as from the sparsity and event-driven nature of spike-based synaptic communication. These models enable a fundamentally different and highly energy-efficient paradigm for neural computation, making SNNs attractive for both neuroscientific modeling and next-generation neuromorphic hardware deployment (Jang et al., 2018).

1. Neuron and Dynamical Models

SNNs are constructed from neurons with internal analog dynamics and digital, sparse spike outputs. The most widely adopted discrete-time neuronal model is the LIF neuron, whose update equation is: ui[t+1]=αui[t]+jwijsj[t]+Ii[t]si[t]θu_i[t+1] = \alpha\,u_i[t] + \sum_j w_{ij}\,s_j[t] + I_i[t] - s_i[t]\,\theta where α[0,1]\alpha \in [0,1] is the membrane decay factor, wijw_{ij} the synaptic weight, Ii[t]I_i[t] the external current, θ\theta the threshold, and si[t]{0,1}s_i[t] \in \{0,1\} the binary spike event. Spike emission is determined by a threshold rule: si[t+1]={1if ui[t+1]θ, 0else.s_i[t+1] = \begin{cases} 1 & \text{if } u_i[t+1] \geq \theta, \ 0 & \text{else}. \end{cases} Extensions include conductance-based synapses, refractory currents, and soft thresholding for probabilistic spiking. Continuous-time analogues and other models (e.g., spike-response, Poisson or phase-coded neurons) have also been developed, enabling sophisticated, biologically motivated temporal dynamics (Jang et al., 2018, Skatchkovsky et al., 2020, Jang et al., 2020).

2. Computational and Probabilistic Frameworks

Formally, SNNs adopt probabilistic models where spikes are random variables. Learning is posed as inference over the posterior p(WS)p(W|S), with variational approximations leading to tractable, local learning rules (Jang et al., 2018).

3. Learning Mechanisms and Training Strategies

The non-differentiability of spikes presents unique challenges for applying gradient-based optimization in SNNs. Multiple approaches have emerged:

  • Variational inference: The evidence lower bound (ELBO) is optimized using analytic or Monte Carlo approximations. Gradients are computed using score-function or reparameterization techniques, yielding spike-driven Hebbian and STDP-like updates augmented with weight decay from the prior (Jang et al., 2018).
  • Backpropagation-through-time with surrogate gradients: In deterministic settings, the non-smooth thresholding nonlinearity is replaced with smooth surrogates, such as sigmoid or arctangent functions. This allows the use of chain-rule backpropagation in recurrently unrolled SNNs, and forms the backbone of modern large-scale supervised SNN training pipelines (Skatchkovsky et al., 2020, Jr, 31 Oct 2025).
  • ANN-to-SNN conversion: Pre-trained ANNs (typically using ReLU activations) are mapped directly to SNNs by interpreting node activations as spike rates, scaling weights, and adapting thresholds and time constants. Accurate conversion is attainable for rate-coded SNNs, with errors as low as 0.1–1% on image classification benchmarks (Jang et al., 2020, Dang et al., 2020, Jr, 31 Oct 2025, Su et al., 2024).
  • Local unsupervised plasticity (STDP): Rules based on the relative timing of pre- and post-synaptic spikes (Δwijetposttpre/τ\Delta w_{ij} \propto e^{-|t_\text{post}-t_\text{pre}|/\tau}) drive unsupervised feature extraction in early sensory layers and are amenable to efficient on-chip learning (Jang et al., 2018, Skatchkovsky et al., 2020, Dang et al., 2020, Jr, 31 Oct 2025).

Hybrid paradigms—for example, combining random, fixed reservoirs of nonlinear spiking dynamics with learned linear readouts—have recently demonstrated substantial gains in simplicity, training efficiency, and robustness on a variety of SNN benchmarks (Dai et al., 19 May 2025, Gollwitzer et al., 1 Oct 2025).

4. Coding and Signal Representation

SNNs encode analog information in spikes according to several fundamental schemes:

  • Rate code: Firing frequency proportional to signal amplitude, generally robust but inefficient for rapid, precise computation due to high spike counts.
  • Temporal code: Information is conveyed in spike timing, such as the time-to-first-spike or relative phase within an oscillatory period, enabling much lower latency and far fewer spikes per pattern (Jang et al., 2018, Oh et al., 2020, Bybee et al., 2022, Zhou et al., 2019).
  • Rank-order and population codes: The order or relative timing of spikes in a neuron group encodes features, facilitating temporal multiplexing and redundancy (Jang et al., 2018). Optimal coding strategy is application-dependent. Temporal codes achieve lower latency and power when implemented in neuromorphic hardware, while rate codes may be preferable for robustness or compatibility with rate-trained ANNs (Oh et al., 2020).

5. Applications and System-Level Performance

SNNs support a spectrum of applications demanding real-time and energy-efficient inference:

  • Neuromorphic vision: SNNs process event streams from dynamic vision sensors with low latency (\sim5–10 ms) and high accuracy (>>90%) at millijoule-scale power budgets, as demonstrated on the DVS-Gesture and MNIST-DVS datasets (Skatchkovsky et al., 2020, Jr, 31 Oct 2025).
  • Robotics and edge AI: Event-driven control, feedback, and decision-making for mobile platforms utilize SNNs for low-latency sensorimotor loops, favoring on-chip STDP for adaptability in resource-constrained settings (Jr, 31 Oct 2025).
  • Associative memory: SNNs with columnar architectures and sparse, Poisson-driven neurons have demonstrated robust pattern completion, rivalry, and distortion-resistant memory retrieval, enabled by local unsupervised Hebbian and structural plasticity (Ravichandran et al., 2024).
  • Template matching: SNNs trained via STDP and ambiguity-informed weighting perform state-of-the-art visual place recognition, degrading gracefully with scale and supporting sub-millisecond hardware realization (Hussaini et al., 2021).
  • Communications: SNNs have matched or exceeded classical digital equalizers in decision feedback receiver tasks, leveraging novel ternary spike encoding and demonstrating robust learning via surrogate-gradient BPTT (Bansbach et al., 2022).

Systematic evaluations on classical benchmarks (e.g., MNIST, CIFAR-10) reveal that SNNs using surrogate-gradient or precise conversion methods approach within 1–3% accuracy of ANNs, while unsupervised STDP-based SNNs offer the lowest energy and spike-count at the cost of slower convergence (Jr, 31 Oct 2025). Hardware studies document energy per inference reductions of 10×10 \times or greater relative to conventional digital accelerators (Oh et al., 2020, Carpegna et al., 2022, Dang et al., 2020, Bybee et al., 2022).

6. Architectures, AutoML, and Training Scalability

SNNs can be realized in both biologically inspired and machine-optimized topologies:

  • Randomized/Reservoir architectures: Fixed random LIF reservoirs followed by learnable readout layers (RanSNN, S-SWIM) nearly match fully trained SNNs, while drastically reducing the number of trainable parameters and training compute (Dai et al., 19 May 2025, Gollwitzer et al., 1 Oct 2025).
  • Automated Neural Architecture Search (NAS): Recent advances in SNN-specific NAS have discovered hybrid feedforward-feedback cell motifs and backward temporal connections that outperform hand-tuned VGG/ResNet backbones, yielding state-of-the-art accuracy with orders of magnitude fewer simulation steps (Kim et al., 2022).
  • Exact quantized conversion for recurrent models: Novel methods (e.g., Quantized CRNN→SNN Conversion) achieve provably lossless mapping of quantized convolutional/recurrent ANNs to BIF/RBIF SNNs, guaranteeing vanishing conversion error and strong performance even on long sequence tasks (Su et al., 2024).

Scalable training remains a challenge due to the temporal depth and non-differentiability of discrete spike events. Surrogate-gradient-based and fully conversional approaches have mitigated, but not eliminated, these limitations.

7. Theoretical, Algorithmic, and Practical Challenges

Despite empirical progress, several open problems and theoretical questions persist:

  • Efficient and biologically plausible credit assignment in deep, multilayer SNNs remains unsolved (Jang et al., 2018).
  • Trade-offs between temporal and rate coding are not mathematically settled, especially for robustness under noise and device variability (Jang et al., 2018, Oh et al., 2020).
  • Comprehensive convergence and generalization analysis for stochastic SNN training algorithms is lacking, impeding theoretical guarantees (Jang et al., 2018, Jr, 31 Oct 2025).
  • Lack of unified, hardware-agnostic software toolchains hinders large-scale adoption and benchmarking (Jr, 31 Oct 2025).
  • Hybrid and mixed-precision architectures integrating continuous and event-based representations, especially for deployment in heterogeneous neuromorphic platforms, remain a research frontier.

SNNs continue to advance both as principled models of neural computation and as a practical basis for energy-efficient neuro-inspired hardware, with continuing efforts in theoretical analysis, scalable training, and real-world deployments across robotics, sensing, communications, and memory systems (Jang et al., 2018, Skatchkovsky et al., 2020, Jr, 31 Oct 2025).
