Conflict-free MOO methods are typically scalable in both the number of objectives and problem size due to localized quadratic subproblems (PAMOO, MGDA), projection operations (JD, ConFIG), or subpopulation decomposition (GSF). For convex aligned optimization, complexity is linear in mm per step; for projection-based aggregation, dual QP solvers become practical up to hundreds of objectives (Kretzu et al., 6 Sep 2025, Quinton et al., 2024).

Key practical guidelines include:

  • Apply conflict-free MOO in multi-task learning and RL where objectives appear aligned or trade-offs are undesirable.
  • Use empirical gradient concordance metrics and monitor loss trajectories to detect feasible alignment.
  • Prefer adaptive weight selection (Polyak gain, curvature optimization) and conflict-free projection aggregators where scale and stability are priorities.
  • Subpopulation frameworks and disjoint cost splitting optimize coverage and runtime in population-based or combinatorial settings (Vargas et al., 2019, Ge et al., 2022).

7. Limitations, Extensions, and Future Directions

While conflict-free approaches offer robust optimization, limitations arise when objectives are only approximately aligned or when objective landscapes are highly non-linear. Projection-based aggregation may encounter computational bottlenecks for very large mm without Gramian/structure-based acceleration (Quinton et al., 2024). M-ConFIG’s per-loss momentum storage becomes prohibitive as mm increases, demanding sampling or sparse update strategies (Liu et al., 2024).

Extensions under active investigation include:

  • Second-order curvature adaptation for non-convex deep learning models;
  • Stochastic and adaptive trust-region QP solvers for RL and constrained MOO (Kim et al., 2024);
