The Spectral Sampling Framework (SSF) refers to a family of statistical, algorithmic, and information-theoretic methodologies for optimally selecting sample locations—often adaptively—in order to maximize inference accuracy, information gain, or stability for spectral signals arising in fields such as optical spectroscopy, compressive sensing, signal processing, and imaging. Classical fixed-rate sampling, as mandated by the Nyquist–Shannon theorem, is subsumed within SSF as a special case of ignorance-optimal design. Recent advances have generalized SSF to incorporate Bayesian priors, nonlinear measurement operations, data-driven hardware constraints, and various optimization objectives. The framework is instantiated in practical domains including adaptive autocorrelation spectroscopy, high-dynamic-range sub-Nyquist frequency estimation, neural-optimal Fabry–Pérot spectral sampling, and model-based compressive sensing, with formal guarantees on performance and information acquisition (Schroeder et al., 20 May 2025, Guo et al., 2024, Baso et al., 2023, Öztireli, 2019, Farnell et al., 2019).

1. Bayesian Information-Optimal Sampling

The core of SSF is the explicit modeling of the measurement process as a Bayesian statistical inference problem. In the uninformed prior limit (ΣpriorαI\Sigma_{\text{prior}} \to \alpha I), this recovers D-optimality and classical uniform Nyquist sampling. With structured priors, sample locations are adaptively concentrated where spectral uncertainty is maximal (Schroeder et al., 20 May 2025).

2. Adaptive and Greedy Sampling Algorithms

SSF typically employs a sequential, myopic-greedy policy:

  1. For current estimate (μn1,Σn1)(\mu_{n-1}, \Sigma_{n-1}), evaluate expected information gain ΔI(τ)\Delta I(\tau) over candidate sample locations.
  2. Select τn=argmaxτΔI(τ)\tau_n = \arg\max_\tau \Delta I(\tau).
  3. Acquire measurement, update posterior mean and covariance.
  4. Repeat until stopping criterion (e.g., uncertainty floor or measurement budget) is satisfied.

This adaptive protocol provably never yields worse posterior uncertainty than the uniform grid (as measured by determinant of posterior covariance) and reduces the number of required samples for target fidelity when informative priors are used. For linear-Gaussian problems, one-step Bayes-optimality holds: each selection maximizes immediate information gain (Schroeder et al., 20 May 2025).

3. Sub-Nyquist and Nonlinear Spectral Sampling

SSF methodologies extend to architectures involving nonlinear measurement maps, such as modulo-ADC (folding) systems, enabling recovery of signals that exceed classical dynamic range and violate Nyquist constraints. In the Unlimited Sensing Framework (USF), a multi-channel, modulo-based sampling apparatus captures all necessary spectral information for a sum of sinusoids:

The USF guarantees exact recovery (for arbitrary amplitudes and frequencies) from $6K+4$ modulo samples—independent of base sampling rate or amplitude range—by exploiting cross-channel differences (range unfolding) and time-delays (frequency unfolding) with Prony's method and residue separation (Guo et al., 2024). Hardware implementations demonstrate reconstruction of kHz-range signals using Hz-range ADC sampling rates (as low as 0.078% Nyquist), robust to extreme dynamic range and low precision.

4. Data-Driven and Neural Information-Based Sampling

For complex high-dimensional spectra, eg., Fabry–Pérot solar observations, SSF incorporates data-driven, neural feature-selection methods. Sampling locations are sequentially chosen using neural surrogates (e.g., small residual networks) trained to minimize spectral or physical parameter reconstruction error. Both unsupervised (direct spectrum fidelity) and supervised (parameter inference) criteria are supported:

  • At step pp, select next wavelength maximizing mean-squared prediction error on held-out wavelengths (unsupervised) or maximizing parameter inference improvement (supervised).
  • The resulting scheme naturally allocates denser samples to rapidly-varying spectral regions (e.g., line cores for magnetic diagnostics) and sparser samples elsewhere.

Quantitative evidence shows this approach achieves 50% faster MSE decay and significantly improved parameter inference (e.g., 30% lower RMS error in chromospheric temperature for P=5P=5; 4× lower B_LOS RMS error for magnetic field estimation at P=21P=21), consistently outperforming uniform grids (Baso et al., 2023).

5. Variational and Spectral-Domain Optimization for Anti-Aliasing

In imaging and spatial signal applications, SSF provides a variational approach to sampling pattern design via power spectral optimization. The L2 reconstruction error from a sampling pattern with power spectrum P(ω)P(\omega) is:

This formalism clarifies the fundamental trade-offs in noise, aliasing, and spatial correlation for arbitrary sampling strategies (Öztireli, 2019).

6. Extensions: Compressive Sensing, Graph, and Learning Theoretic Perspectives

SSF encompasses and extends to:

  • Compressive Sensing: Empirically-driven maximal-variance sampling orders are constructed by ranking measurement vectors according to empirical variance on representative datasets. This outperforms classical random or structured (sequency/frequency) orderings and is agnostic to the choice of hardware-compatible basis (Walsh–Hadamard, DCT, learned dictionaries) (Farnell et al., 2019).
  • Adaptive Sampling in Learning: Generalization error is decomposed spectrally by overlap integrals between sampler power spectra PS^(ω)\widehat{\mathcal{P}_S}(\omega) and target function spectra, providing explicit design guidelines for constructed samplers (blue noise, Poisson disk) to suppress error in desired frequency bands (Kailkhura et al., 2019).
  • Graph Signal Sampling: The spectral framework underpins node selection into sampling sets by proxies for cut-off frequency, associated to powers of graph Laplacians, enabling bounds and guarantees on stable recovery of bandlimited graph signals (Anis et al., 2015), as well as dual vertex-spectral domain theory for arbitrary graphs (Shi et al., 2021).

7. Practical Impact and Theoretical Guarantees

SSF yields rigorous advantages and broad applicability:

  • Performance Guarantees: Adaptive SSF never underperforms Nyquist-uniform baseline; with informative priors, it offers substantial efficiency and accuracy gains (Schroeder et al., 20 May 2025).
  • Real-Time Operation: Adaptivity and data-driven selection enable on-the-fly implementation (e.g., MRI kk-space, hyperspectral imaging, real-time MAC graph registration with stochastic Laplacian filters) (Levine et al., 2017, Zhang et al., 2024).
  • Transferability: Prior knowledge from curated or simulated datasets, physical models, or learned statistics is seamlessly infused into the sampling design, ensuring context-aware sampling in scientific instrumentation, estimation, and detection domains.
  • Extensibility: Supports nonlinear, quantized, and hardware-constrained acquisition, and bridges the spectrum from classical deterministic to stochastic and neural-driven frameworks.
