The notion provides a rigorous framework for differentiating mappings between infinite-dimensional function spaces, for differentiating the solution map of stochastic or nonsmooth dynamical systems, and for quantifying the influence or sensitivity of functionals in statistical models.

1. Definitions and Fundamental Structures

The precise content of "pathwise differentiability" varies with context, but is anchored in the ability to linearize the map of interest along absolutely continuous paths in its domain. For a function f:RnRmf:\mathbb{R}^n \to \mathbb{R}^m, pathwise differentiability requires the existence of a conservative Jacobian DcfD^c f (set-valued, locally bounded, graph-closed) such that for any absolutely continuous trajectory y:[0,1]Rny:[0,1]\to\mathbb{R}^n and almost all tt,

2. Pathwise Differentiability in Dynamical Systems

In ordinary and stochastic differential equations, pathwise differentiability governs the sensitivity of the solution flow with respect to inputs, controls, or initial data. In the context of deterministic ODEs with vector field F:RnRnF:\mathbb{R}^n\to\mathbb{R}^n, if FF admits a conservative Jacobian, then the time-tt flow xϕ(x,t)x\mapsto\phi(x,t) is itself path differentiable (Marx et al., 2022). This is established by lifting the chain rule to flows and propagating derivatives via the variational inclusion

In second-order SDEs driven by H\"older-continuous paths, or fractional Brownian paths with Hurst index H>1/2H>1/2, the map xz(x)x\mapsto z(x) given by

In reflected diffusions and stochastic flows in convex polyhedral domains, directional derivatives of the extended Skorokhod map Γ\Gamma exist as solutions to derivative Skorokhod-type problems up to the first encounter with pathological boundary sets. The right-continuous version of these derivatives solves a linear constrained SDE with reflection, describing the pathwise derivative process Jα,x[β,y]J^{\alpha,x}[\beta,y] (Lipshutz et al., 2016, Lipshutz et al., 2017).

3. Pathwise Differentiability and Semiparametric Statistics

In semiparametric models, pathwise differentiability encodes the existence and precise form of influence functions for statistical functionals. For a smooth map Ψ:PR\Psi: \mathcal{P}\to\mathbb{R} on a model of dominated probability measures, Ψ\Psi is pathwise differentiable at P0P_0 if there exists φL2(P0)\varphi \in L^2(P_0) such that for all regular submodels PtP_t with score ss,

This property ensures regularity and asymptotic normality of efficient estimators. Recent research establishes that pathwise differentiability and Neyman orthogonality of associated estimating equations are formally equivalent under a local product structure condition linking target and nuisance parameters (Chen et al., 16 Mar 2026). In canonical examples such as average treatment effect (ATE) estimation, this framework yields the classical efficient influence function and guarantees the validity of debiased machine learning procedures.

4. Nonsmooth Analysis and Implicit Function Calculus

Pathwise differentiability extends to nonsmooth and set-valued analysis, utilizing concepts such as conservative Jacobians and the Clarke generalized derivative. If FF is path differentiable and the mapping xx(θ)x\mapsto x^*(\theta) defined implicitly by F(θ,x(θ))=0F(\theta, x^*(\theta))=0 is locally unique and regular, then xx^* is path differentiable via a generalized chain rule and the nonsmooth implicit function theorem. In monotone operator inclusions, this yields explicit Clarke-type back-propagation rules for the sensitivity of solutions to parametric changes, which underpin automatic differentiation in nonsmooth optimization algorithms. Under strong monotonicity and contractivity, the solution mapping is differentiable almost everywhere and admits a compact conservative Jacobian formula (Bolte et al., 2022).

5. Pathwise Derivative Calculus for Random Fields and PDEs

In functional stochastic analysis, pathwise differentiability is formalized through calculus on the space of sample paths, using tools such as Dupire's path derivatives. Pathwise Taylor expansions for regular random fields admit expressions in terms of higher-order path derivatives and multiple stochastic integrals, generalizing classical expansions to the infinite-dimensional random path setting:

6. Applications: Variational Inference, Optimization, and Sensitivity Analysis

Pathwise differentiability enables efficient and unbiased gradient estimation in variational inference, especially for families of distributions lacking simple reparameterizations. The transport equation approach constructs velocity fields that ensure the unbiasedness of estimators for θL=Eqθ[zfvθ]\nabla_\theta \mathcal{L} = \mathbb{E}_{q_\theta}[\nabla_\mathbf{z} f \cdot \mathbf{v}^{\theta}], with adaptive control variates modifying null fields to reduce variance (Jankowiak et al., 2018). In the analysis of reflected diffusions and queueing networks, sensitivity of the solution with respect to parameters is accessible via the pathwise derivative process, facilitating gradient-based design and robust performance optimization (Lipshutz et al., 2016, Lipshutz et al., 2017).

In summary, pathwise differentiability provides a unified language and toolkit for analyzing sensitivity, enabling chain-rule calculus and differentiable programming in both smooth and nonsmooth, deterministic and stochastic, finite- and infinite-dimensional settings. This continues to drive advances in sampling, inference, optimal control, and algorithmic differentiation.
