Physics-constrained adaptive learning frameworks are a family of neural and hybrid machine learning methodologies that integrate physical laws, domain constraints, and often adaptive mechanisms into the core of the learning or control process. These frameworks bridge gaps between pure data-driven models and established scientific or engineering models, enabling more reliable, efficient, and interpretable learning, especially for tasks governed by partial differential equations (PDEs), constrained optimization, control, or safety-critical decision-making. A key differentiator is the use of explicit physical constraints—often formulated as PDEs or conservation laws—that are imposed adaptively, either through sampled collocation, penalty-adjusted optimization, or bilevel/auxiliary variable methods, yielding significant gains in solution accuracy, robustness, and practical feasibility.

2. Adaptive Collocation Algorithms and Complexity

The core adaptive training algorithm is a joint process of periodic collocation point resampling (with adaptive/uniform split determined by a cosine-annealed schedule) and model parameter updates:

  1. Initialize θ\theta and candidate collocation pool, compute initial PiP^i.
  2. For each training epoch tt:

This maintains a fixed computational budget: the total number of residual evaluations remains O(nc)O(n_c), with the extra gradient proxy calculation piggybacked on autodiff computations, yielding only 10≈10–$20$\% computational overhead and 5\lesssim5\% wall-clock increase relative to vanilla PINNs (Subramanian et al., 2022).

3. Empirical Performance and Robustness

Adaptive sampling via the described framework produces marked empirical gains, especially in the low-collocation regime. On 2D Poisson and advection–diffusion PDEs, baseline PINNs with nc=1000n_c = 1\,000 collocation points yielded solution errors μ20.53\mu_2 \approx 0.53–$0.71$ (i.e., 53–71%), stalling on sharp-forcing cases.

Uniform resampling reduced errors for smooth cases but failed for highly localized forcing. 4. Extensions to General Physics-Constrained Learning

The adaptive methodology extends to:

  • Systems of PDEs: Vector-valued residuals yield per-component gradient proxies; adaptive sampling balances accuracy across system constituents.

  • Hybrid data-driven surrogates: Adaptivity may target regions of high epistemic or aleatoric uncertainty, turning the collocation process into uncertainty-reducing active learning.

Thus, the physics-constrained adaptive learning paradigm generalizes to any setting where "self-supervised" physics-constrained model training must exploit limited data or compute to optimize prediction fidelity (Subramanian et al., 2022).

Repeated, proxy-driven adaptive reallocation—focusing the learning signal on regions that are sharp, underresolved, or physically sensitive—can yield up to 10× improvement in solution accuracy without an increase in computational cost, particularly in challenging, low-data regimes.

By embedding the physics constraint as an active process in the training loop, this approach delivers a principled, scalable, and extensible pathway for integrating scientific laws with deep learning, suitable not only for academic model problems but also for complex, multi-faceted industrial and scientific applications (Subramanian et al., 2022).
