- Interpretability: The latent spaces learned by hypernet-based NIFs do not always correspond to physically interpretable modal coordinates or reveal clear dynamical invariants, as seen in comparative studies with DeepONet or projection-based approaches (Nasim et al., 2024).
- Physics constraints: Unless explicitly enforced, learned flows are not guaranteed to satisfy conservation (e.g., mass, momentum) or boundary conditions. Integrating physics-informed losses and divergence-free constraints is a target for future work (Vito et al., 2024).
- Unsteady phenomena: Most NIF surrogates for scientific computing to date target steady or single-parameter flows, with extension to high-dimensional, unsteady, or multi-physics domains an ongoing area of development (Vito et al., 2024).
- Training complexity: Hypernetwork tuning, MLP depth/width, and regularization parameters have significant impact on expressivity and generalization; model selection remains a nontrivial step (Jiao et al., 2023).
- Latent space geometry: Manifolds learned by latent-ODE or NIF schemes can lack the geometric structure (e.g., invariant tori) seen in explicit modal decompositions, complicating analysis and controllability (Nasim et al., 2024).
7. Comparative Position and Future Directions
NIF methods define a rapidly expanding class of neural operator and implicit representation architectures. In direct comparison:
- Versus classic linear/nonlinear dimensionality reduction: NIF achieves superior generalization, data- and parameter-efficiency, and the capacity to represent complex nonlinear, topology-varying systems (Pan et al., 2022, Nasim et al., 2024).
- Versus DeepONet: NIF achieves lower forecasting error—but DeepONet often yields more interpretable latent manifolds (Nasim et al., 2024).
