Force Generative Models: A Physical Approach

A force generative model is a class of generative probabilistic models in which the generative process is either directly governed by, or incorporates, physically or mathematically inspired force fields, dynamical systems, or explicit physical interactions. These models unify statistical, neural, or diffusion-based approaches with deterministic or stochastic dynamics derived from physics, yielding rich frameworks that enable principled conditioning, interpretability, and accurate control of dynamics, structure, or equilibrium in a variety of scientific and engineering domains.

1. Mathematical Foundations: Force Fields and Dynamical Priors

The cornerstone of force generative modeling is the explicit incorporation of force fields—vector fields motivated by classical or statistical physics—into the latent or observation models. A canonical example arises in latent force models (LFMs), where a physical ODE describes the evolution of observable amplitudes subjected to latent sources. For example, in sound synthesis the amplitude envelope xm(t)x_m(t) of the m-th subband is governed by

Beyond LFM, force generative models instantiate force fields in a variety of forms. In ODE-style generative diffusion, the data transformation is mapped via a vector field Ft(x)\mathbf{F}_t(\mathbf{x}) defined to be divergence-free in space-time, e.g. Coulomb/Poisson vector fields or more general Green’s-function-derived flows (Jin et al., 2023). 2. Representative Model Classes and Architectures

Multiple modeling paradigms realize force generative models across scientific domains:

  • Latent Force Models (LFM): LFMs solved via Gaussian process regression or state-space inference. The model stacks states such as amplitude envelopes and GP parameters, discretizes via Euler steps, and observes via linear operators. Inference employs approximate nonlinear Kalman filters and marginal likelihood maximization (Wilkinson et al., 2018).
  • Physics-Guided GANs and Diffusion Models: Force fields can enter as explicit components in the generator or guide sampling through classifier-style guidance. In surface structure discovery, the generative diffusion is augmented at each reverse step by an equivariant learned force field that guides towards low-energy configurations (Rønne et al., 2024). For molecular conformer generation, diffusion steps are constructed analogously to the bond, angle, and torsion terms of classical force fields, and learn atom-typing via graph attention (Williams et al., 2024).
  • Equivariant Diffusion with ML Force Fields: In 3D geometric generative modeling (e.g. molecules), E(3)-equivariant diffusion models are fine-tuned by reinforcement learning on foundation force fields, yielding fast, physically aligned generative samplers (Li et al., 29 Jan 2026).
  • GANs with Physical or Universal Force-Field Discrimination: For crystalline and topological material generation, force fields are embedded via advanced discriminators (e.g., message-passing neural potentials such as CHGNet) or universal force-field engines (UFFs), enabling automatic bias toward dynamically stable, energetically favorable candidate structures (Tyner, 7 Apr 2025, Wang et al., 28 Feb 2025).
  • Stochastic/Deterministic Planning and Control in Video/Robotics: Recent “force prompting” and “goal force” models use explicit force or goal fields as conditioning tensors in video generation, with architectures based on ControlNet, Mixture-of-Experts DiT, and physics-masking curricula to achieve out-of-domain physics-aware planning (Gillman et al., 26 May 2025, Gillman et al., 9 Jan 2026).

3. Inference, Learning Procedures, and Physical Conditioning

Inference in force generative models generally requires integrating or sampling from nonlinear and potentially non-Gaussian state-space models. In LFMs, approximate cubature Kalman filtering is necessary due to nonlinearities introduced by feedback and non-exponential damping (Wilkinson et al., 2018). In diffusion frameworks, the denoising or score-matching networks are trained under variational, score-matching, or policy-gradient losses guided by force-derived rewards or energy-shaping terms (Li et al., 29 Jan 2026, Holderrieth et al., 2024).

Physical conditioning is effected by synthesizing or inputting force or property profiles (such as unfolding force-separation curves in de novo protein design) and feeding these as conditioning tokens or attention vectors throughout the model (Ni et al., 2023). In conditional video generation, spatial-temporal force tensors are injected as additional channels or via cross-attention into the U-Net or transformer blocks (Gillman et al., 26 May 2025, Gillman et al., 9 Jan 2026). In reinforcement learning alignment for molecular diffusion, group-normalized, disentangled rewards for energy and force achieve low-energy, mechanically stabilized equilibrium distributions at no additional inference cost (Li et al., 29 Jan 2026).

4. Empirical Validation and Comparative Analysis

Rigorous evaluation of force generative models relies on both standard generative metrics and physically meaningful quantities. In natural sound modeling, envelope RMS and cosine error are benchmarked against NMF variants; perceptual listening tests (GLMM, n=24) demonstrate a statistically significant improvement in realism (LFM over NMF and tNMF, p<.001p < .001), driven by the imposition of physical priors (Wilkinson et al., 2018).

In generative surface structure prediction, force-guided diffusion outperforms ab initio random structure search both in finding lower-energy configurations (by ~0.1–0.2 eV) and in computational efficiency (requiring up to 10X less relaxation time per candidate) (Rønne et al., 2024). In drug-like conformer generation, a classical force-informed diffusion model achieves sub-milliangstrom accuracy in bond/angle/torsion statistics, surpassing knowledge-based methods (Williams et al., 2024).

In 2D crystal GANs, fine-tuning with a universal force-field discriminator increases the rate of stable + insulating structures produced from nearly 0% to >10%, with DFT validation confirming state-of-the-art success rates for non-trivial topological insulators (Tyner, 7 Apr 2025). In E(3)-equivariant molecular diffusion, RL fine-tuning with foundational force fields yields conformers with systematically lower DFT energy and force RMS, and sampling time identical to undirected models (Li et al., 29 Jan 2026).

5. Physical Interpretability, Inductive Bias, and Model Flexibility

A major appeal of force generative models is explicit physical interpretability: latent variables, outputs, or sampling paths have direct correspondences with physical sources, responses, or forces. The LFM approach, by enforcing ODE-driven priors and feedback, captures onset, decay, and feedback phenomena in temporal signals, with latent variables interpretable as physical control signals (Wilkinson et al., 2018).

ODE-type diffusion models grounded in divergence-free vector fields (e.g., Poisson/Coulomb, harmonic oscillators) enable geometric interpretation of data flows, speed-quality trade-offs (linear, superposition, curved paths), and continuous generalization from conservative to dissipative physical regimes (Jin et al., 2023, Holderrieth et al., 2024). In drug-like molecule conformer sampling, accurate bonded structures are attributed to the built-in force-field constraints and the network’s on-the-fly, data-driven atom typing (Williams et al., 2024).

Flexible conditioning, achieved by incorporating arbitrary physical signals (resistances, force tensors, trajectory goals) as first-class inputs, enables real-time, controlled generation across tasks: video synthesis with force-aware planning, protein and material design with mechanical objectives, and human-object interaction with explicit force/resistance encoding (Gillman et al., 26 May 2025, Ni et al., 2023, Zhang et al., 2024). Force generative frameworks are thus inherently extensible: new physical goals or constraints can typically be appended to architectures without retraining the underlying prior.

6. Applications and Impact

Force generative models have demonstrated significant impact across diverse areas:

  • Audio and Temporal Signal Modeling: LFM-based ODEs accurately synthesize percussive and impact sounds, outperforming NMF baselines in perceptual realism and physical plausibility (Wilkinson et al., 2018).
  • Protein Design: Diffusion models conditioned on full unfolding force-separation curves resolve detailed mechanical properties (toughness R2=0.93R^2 = 0.93), supporting the de novo discovery of mechanically targeted proteins (Ni et al., 2023).
  • Molecular and Materials Simulation: The PFD workflow enables rapid, automated generative force-field creation for arbitrary complex materials from foundation models, supporting large-scale MD with minimal DFT cost (Wang et al., 28 Feb 2025).
  • Surface Structure and Crystal Generation: Force-guided diffusion and GANs with universal force-field discrimination drive atomic and supercell structures toward energetic and/or topological targets unattainable by data-only models (Rønne et al., 2024, Tyner, 7 Apr 2025).
  • Human Interactions and Control: Video models and imitation learning frameworks explicitly conditioned on force and resistance generalize to complex tool chains, real-world manipulation, and contact-rich robotics tasks with stable closed-loop control (Gillman et al., 9 Jan 2026, Sato et al., 6 Feb 2026, Zhang et al., 2024).

7. Limitations and Future Directions

Despite their successes, current force generative models face open challenges: scaling to high-dimensional and multi-modal distributions may induce sensitivity to hyperparameters or require high-quality, physically enriched data. Handling nonrigid, fluid, or multiscale systems often requires domain-specific augmentation. Error modes can include mode collapse (in group trajectory flow), unphysical sampling under guidance, or instability in feedback-controlled settings. Ongoing efforts aim to blend learned and analytic force fields, extend to richer physics (e.g., fluid/elastic effects), automate divergence-free kernel discovery, and integrate physical guidance with closed-loop planners (Jin et al., 2023, Sato et al., 6 Feb 2026).

A continued trend is the modularization and “foundation-model” paradigm—fine-tuning or transferring force generative models across domains and scaling architectures to fuse physical conditioning, energy alignment, and control (Wang et al., 28 Feb 2025, Li et al., 29 Jan 2026, Ni et al., 2023). This direction promises to bridge first-principles accuracy, generative flexibility, and physical interpretability across scientific applications.
