PARCv2: Physics-Aware Neural PDE Solver

  • Modular training separation: The network decomposes the prediction task into learning the instantaneous spatiotemporal derivatives (physics-informed, parameter-efficient), and separately, the integration correction (data-driven, high-order error compensation).

No explicit physics-informed loss (such as PDE residual enforcement or divergence penalties) is imposed during training or rollout; instead, conservation and invariance are maintained implicitly by the network’s architectural constraints.

PARCv2 is applicable to nonlinear field evolution problems including:

Optimization employs Adam with decaying learning rates, with hyperparameters such as batch size and epochs tailored to each benchmark. For example, Burgers’ equation is trained with batch size 16, 100–150 epochs and learning rate 10−310^{-3}, while energetic material simulation uses smaller batch sizes and longer (stage-wise) training (Nguyen et al., 2024, Cheng et al., 8 Oct 2025).

In the energetic materials context, a curriculum of one-step and three-step prediction stages is adopted, each comprising thousands of epochs. PARCv2 demonstrates:

  • RMSEs approximately half that of FNO on velocity fields.

  • Minor divergence-free violations in incompressible Navier–Stokes settings owing to lack of explicit divergence penalization.
  • Mild underprediction of distribution tails (extreme temperature/pressure) due to reliance on data-driven rather than residual-based loss.
  • All deep-learning baselines, including PARCv2, exhibit spectral bias—weak, high-frequency features (e.g., secondary shear bands) are diffused out during extrapolation.

In terms of computational cost, PARCv2 achieves forward-inference times three to four orders of magnitude faster than DNS on comparable hardware.

6. Improvements over PARC and Domain-Specific Adaptations

Key advances over the original PARC framework include:

  • Upwind advection replaces right-difference derivatives, improving stability and eliminating spurious oscillations in low-Mach or weak shock regimes.

7. Extensions and Prospective Directions

PARCv2 establishes a foundation for hybrid numerical–learning approaches in fields requiring robust, generalizable, and efficient simulation of nonlinear PDEs. Suggested future extensions include:

  • Incorporation of soft physics constraints (e.g., divergence-free penalties) during or post-training to enforce physical invariants precisely.
  • Extension to spatially variable coefficients (heterogeneous media), anisotropic operators, or higher-order equations (e.g., Cahn–Hilliard).
  • Generalization of the differentiator–integrator paradigm to stochastic or diffusion-based models outside fluid dynamics (e.g., neural SDEs/ODEs, generative diffusion models).

A plausible implication is that the separation of physics-informed differentiation and data-driven integration can be adapted for other operator-learning frameworks, mitigating spectral bias and improving stability in a wide class of temporally evolved systems (Nguyen et al., 2024, Cheng et al., 8 Oct 2025).
