Towards Realistic Individual Recourse and Actionable Explanations in Black-Box Decision Making Systems (1907.09615v1)

Abstract: Machine learning based decision making systems are increasingly affecting humans. An individual can suffer an undesirable outcome under such decision making systems (e.g. denied credit) irrespective of whether the decision is fair or accurate. Individual recourse pertains to the problem of providing an actionable set of changes a person can undertake in order to improve their outcome. We propose a recourse algorithm that models the underlying data distribution or manifold. We then provide a mechanism to generate the smallest set of changes that will improve an individual's outcome. This mechanism can be easily used to provide recourse for any differentiable machine learning based decision making system. Further, the resulting algorithm is shown to be applicable to both supervised classification and causal decision making systems. Our work attempts to fill gaps in existing fairness literature that have primarily focused on discovering and/or algorithmically enforcing fairness constraints on decision making systems. This work also provides an alternative approach to generating counterfactual explanations.

Individual Recourse and Actionable Explanations in Black-Box Decision-Making Systems

This enables suggestions that are more pragmatic and achievable.

For instance, the paper details experiments using the UCI defaultCredit dataset where the model effectively provides revised recourses suggesting modifications in financial attributes, such as "Most Recent Payment Amount," with a view towards turning a potential default into a non-default scenario. The authors highlight that unlike some existing methods, their approach avoids unrealistic suggestions like drastic increases in income, favoring instead, more plausible recommendations like consistent improvements in bill payments.

Furthermore, the paper examines the algorithm's efficacy in providing recourse in systems modeled for causal decision-making. By leveraging latent variable models to infer hidden confounders, the approach demonstrates how recourses can be derived in the presence of unobserved biases—a significant step forward in ML fairness. They utilize a conditional causal model form, as exemplified in their application on the TWINS dataset, underscoring the framework’s capacity to handle immutable attributes (e.g., gender or birth month) to conditionally tailor actionable recourses.

Considering paths for future research, a deeper exploration into generative frameworks that predict realistic scenarios more accurately could further enhance the efficacy of recourses proposed. Moreover, additional investigation into adversarial conditions and the robustness of these recourses across diverse datasets and model biases presents a promising direction to solidify the real-world applicability of this work. With the ongoing emphasis on transparency and fairness in AI, this paper sets a foundational step towards nurturing an AI ecosystem that is not only considerate of alignment and accountability but active in effectuating positive outcomes.
