Recent Advances in Physical Reservoir Computing: A Review (1808.04962v3)
Abstract: Reservoir computing is a computational framework suited for temporal/sequential data processing. It is derived from several recurrent neural network models, including echo state networks and liquid state machines. A reservoir computing system consists of a reservoir for mapping inputs into a high-dimensional space and a readout for pattern analysis from the high-dimensional states in the reservoir. The reservoir is fixed and only the readout is trained with a simple method such as linear regression and classification. Thus, the major advantage of reservoir computing compared to other recurrent neural networks is fast learning, resulting in low training cost. Another advantage is that the reservoir without adaptive updating is amenable to hardware implementation using a variety of physical systems, substrates, and devices. In fact, such physical reservoir computing has attracted increasing attention in diverse fields of research. The purpose of this review is to provide an overview of recent advances in physical reservoir computing by classifying them according to the type of the reservoir. We discuss the current issues and perspectives related to physical reservoir computing, in order to further expand its practical applications and develop next-generation machine learning systems.

- VLSIs: Efforts towards integrating RC circuits onto chips for higher performance and energy efficiency. This includes general-purpose ANN ASICs used as reservoirs and specialized neuromorphic VLSI designs, often employing asynchronous pulse processing and biologically-inspired learning rules for the readout.
- Memristive RC: Reservoirs utilizing memristive elements, whose resistance depends on past current flow, providing inherent memory and nonlinearity. This includes neuromemristive circuits combining memristors as synapses with neuron models, and pure memristive networks or arrays exploiting the collective dynamics of memristors. These have been explored for image recognition and time series prediction, with prototypes fabricated. Atomic Switch Networks (ASNs), a type of self-assembled nanowire network exhibiting memristive behavior, have also been investigated for waveform generation.
3. Photonic RC:
- Leverages the speed and bandwidth of light for high-speed computation.
- Optical Node Arrays: Networks of interacting optical nonlinear elements like semiconductor optical amplifiers (SOAs) or microring resonators integrated on chips. Light signals propagate through the network, exhibiting complex dynamics. These have been demonstrated for logical operations and pattern recognition, though challenges include optical losses and the need for high I/O rates.
- Time-Delay Systems: Optical implementations of the single-node reservoir with delayed feedback. This can be opto-electronic (light-to-electronic conversion in the loop) or all-optical (using optical gain/nonlinearity in the loop). These systems can process signals at very high rates (GHz range) and have been successful in chaotic time series prediction, channel equalization, and spoken digit recognition. Various components like lasers, modulators, and fiber loops are used. Using feedback directly into a laser cavity is another variant. Recent work explores online training methods for these systems.
4. Spintronic RC:
- Utilizes spin dynamics in magnetic materials, promising low-power and small-scale devices.
